EEG Signal Processing in Motor Imagery Brain Computer Interfaces with Improved Covariance Estimators
Desde hace unos años hasta la actualidad, el desarrollo en el campo de los interfaces cerebro ordenador ha ido aumentando. Este aumento viene motivado por una serie de factores distintos. A medida que aumenta el conocimiento acerca del cerebro humano y como funciona (del que aún se conoce relativamente poco), van surgiendo nuevos avances en los sistemas BCI que, a su vez, sirven de motivación para que se investigue más acerca de este órgano. Además, los sistemas BCI abren una puerta para que cualquier persona pueda interactuar con su entorno independientemente de la discapacidad física que pueda tener, simplemente haciendo uso de sus pensamientos.
Recientemente, la industria tecnológica ha comenzado a mostrar su interés por estos sistemas, motivados tanto por los avances con respecto a lo que conocemos del cerebro y como funciona, como por el uso constante que hacemos de la tecnología en la actuali- dad, ya sea a través de nuestros smartphones, tablets u ordenadores, entre otros muchos dispositivos. Esto motiva que compañías como Facebook inviertan en el desarrollo de sistemas BCI para que tanto personas sin discapacidad como aquellas que, si las tienen, puedan comunicarse con los móviles usando solo el cerebro.
El trabajo desarrollado en esta tesis se centra en los sistemas BCI basados en movimien- tos imaginarios. Esto significa que el usuario piensa en movimientos motores que son interpretados por un ordenador como comandos. Las señales cerebrales necesarias para traducir posteriormente a comandos se obtienen mediante un equipo de EEG que se coloca sobre el cuero cabelludo y que mide la actividad electromagnética producida por el cere- bro. Trabajar con estas señales resulta complejo ya que son no estacionarias y, además, suelen estar muy contaminadas por ruido o artefactos.
Hemos abordado esta temática desde el punto de vista del procesado estadístico de la señal y mediante algoritmos de aprendizaje máquina. Para ello se ha descompuesto el sistema BCI en tres bloques: preprocesado de la señal, extracción de características y clasificación. Tras revisar el estado del arte de estos bloques, se ha resumido y adjun- tado un conjunto de publicaciones que hemos realizado durante los últimos años, y en las cuales podemos encontrar las diferentes aportaciones que, desde nuestro punto de vista, mejoran cada uno de los bloques anteriormente mencionados. De manera muy resumida, para el bloque de preprocesado proponemos un método mediante el cual conseguimos nor- malizar las fuentes de las señales de EEG. Al igualar las fuentes efectivas conseguimos mejorar la estima de las matrices de covarianza. Con respecto al bloque de extracción de características, hemos conseguido extender el algoritmo CSP a casos no supervisados. Por último, en el bloque de clasificación también hemos conseguido realizar una sepa- ración de clases de manera no supervisada y, por otro lado, hemos observado una mejora cuando se regulariza el algoritmo LDA mediante un método específico para Gaussianas.The research and development in the field of Brain Computer Interfaces (BCI) has been growing during the last years, motivated by several factors. As the knowledge about how the human brain is and works (of which we still know very little) grows, new advances in BCI systems are emerging that, in turn, serve as motivation to do more re- search about this organ. In addition, BCI systems open a door for anyone to interact with their environment regardless of the physical disabilities they may have, by simply using their thoughts.
Recently, the technology industry has begun to show its interest in these systems, mo- tivated both by the advances about what we know of the brain and how it works, and by the constant use we make of technology nowadays, whether it is by using our smart- phones, tablets or computers, among many other devices. This motivates companies like Facebook to invest in the development of BCI systems so that people (with or without disabilities) can communicate with their devices using only their brain.
The work developed in this thesis focuses on BCI systems based on motor imagery movements. This means that the user thinks of certain motor movements that are in- terpreted by a computer as commands. The brain signals that we need to translate to commands are obtained by an EEG device that is placed on the scalp and measures the electromagnetic activity produced by the brain. Working with these signals is complex since they are non-stationary and, in addition, they are usually heavily contaminated by noise or artifacts.
We have approached this subject from the point of view of statistical signal processing and through machine learning algorithms. For this, the BCI system has been split into three blocks: preprocessing, feature extraction and classification. After reviewing the state of the art of these blocks, a set of publications that we have made in recent years has been summarized and attached. In these publications we can find the different contribu- tions that, from our point of view, improve each one of the blocks previously mentioned. As a brief summary, for the preprocessing block we propose a method that lets us nor- malize the sources of the EEG signals. By equalizing the effective sources, we are able to improve the estimation of the covariance matrices. For the feature extraction block, we have managed to extend the CSP algorithm for unsupervised cases. Finally, in the classification block we have also managed to perform a separation of classes in an blind way and we have also observed an improvement when the LDA algorithm is regularized by a specific method for Gaussian distributions
Estudio del método Common Spatial Patterns y sus variantes en interfaces cerebro-ordenador
Las comunicaciones Brain Computer Interface (BCI) consisten en una tecnología que permite
que las personas puedan comunicarse con una máquina o un ordenador, usando para ello el
cerebro y en la mayoría de los casos un casco de EEG.
Este campo supone un gran reto para la ingeniería (junto con muchas otras ramas de conocimiento)
y en la actualidad se está investigando mucho y se están realizando grandes avances. La importancia
de investigar y avanzar en la realización de estos sistemas se debe a que los sistemas BCI pueden
ser de gran ayuda a personas que sufren de algunos trastornos de parálisis cerebral, o que padecen
de otras enfermedades o discapacidades que impidan el uso normal de sus habilidades motoras. Se
cree que estos sistemas pueden mejorar considerablemente la calidad de vida de estas personas,
para las cuales pequeños avances y cambios implican grandes mejoras.
Common Spatials Patterns (CSP) es un algoritmo muy conocido y ampliamente usado que ha
cobrado gran importancia durante los últimos años por sus aplicaciones en BCI para los sistemas
basados en EEG multicanales. El algoritmo CSP consiste en encontrar un filtro espacial óptimo, que
reduzca la dimensionalidad de las señales originales pudiendo tomar tantos canales como se desee.
El objetivo de este trabajo consiste en realizar un repaso sobre esta técnica y también sobre Linear
Discriminant Analysis (LDA), que se trata de una técnica de clasificación lineal. Además, se ha
implementado un algoritmo basado en CSP con el que se consiguen mejorar los resultados que se
obtienen usando únicamente la técnica de CSP. El algoritmo desarrollado es capaz de distinguir
entre dos clases y además, se ha realizado una extensión en la que se distingue entre cuatro clases
usando un sistema de votaciones simple.
Para poder probar y comprobar el correcto funcionamiento de ambos algoritmos desarrollados,
se han usado los datos procedentes de una competición pública de BCI, que ha sido usada como
referencia en numerosos artículos. Esto nos ha permitido comparar los resultados obtenidos con
nuestros algortimos con aquellos obtenidos mediante otras técnicas y variantes de CSP, como sería
el caso del algoritmo RSTFC, que también ha sido implementado y probado durante este trabajo.
Por último, se han obtenido unas conclusiones de los sistemas BCI, así como de las distintas
técnicas mencionadas anteriormente. Para ello nos hemos ayudado de gráficas y medidas obtenidas
a partir de los resultados obtenidos. También hemos podido extraer conclusiones a partir de
ilustraciones de los filtros espaciales calculados con CSPThe BCI communication is a technology which allows to people to communicate with a machine
or a computer using their own brains and normally a EEG helmet.
This field of knowledge is a great challenge for engineering (and for other fields). Now days BCI
communications are being very studied and developed, having great advances. The importance of
developing better BCI system falls in the believing that it can help a lot of people who are suffering
of some kind of paralysis or some kinds of motor inability. We believe that this technology can be
very useful for those people and that their lifestyle could be increased significantly, to whom little
improvement means a lot.
CSP is very a well-known algorithm and it has been widely used in many BCI system especially
in those systems which use EEG helmets. CSP is used to reduce the dimensionality of the EEG
signals allowing to choose how many channels the user needs.
The main of this work is to make a review in CSP algorithm and about LDA too, which is
a classification technique. Furthermore, an algorithm based on these two techniques has been
developed which improve the results obtained using the simple CSP. The algorithm developed is
able to classify between two classes but an extension have been done making able to distingue
between four imaginary movements. These extension is based in a simple vote system. Whit the
purpose of comparing and checking the well behavior theses algorithms they have been test over a
public set of data. This set of data is given from IV BCI competition. These data have been wildly
used in multiple articles which has allow us to compare the algorithm whit others, like the RSTFC
algorithm which have been also tried in this work.
Finally, some conclusions about BCI system and the algorithm have been done. To accomplish

Optimization of Alpha-Beta Log-Det Divergences and their Application in the Spatial Filtering of Two Class Motor Imagery Movements
The Alpha-Beta Log-Det divergences for positive definite matrices are flexible divergences
that are parameterized by two real constants and are able to specialize several relevant classical cases
like the squared Riemannian metric, the Steins loss, the S-divergence, etc. A novel classification
criterion based on these divergences is optimized to address the problem of classification of the
motor imagery movements. This research paper is divided into three main sections in order to
address the above mentioned problem: (1) Firstly, it is proven that a suitable scaling of the class
conditional covariance matrices can be used to link the Common Spatial Pattern (CSP) solution with a
predefined number of spatial filters for each class and its representation as a divergence optimization
problem by making their different filter selection policies compatible; (2) A closed form formula for
the gradient of the Alpha-Beta Log-Det divergences is derived that allows to perform optimization
as well as easily use it in many practical applications; (3) Finally, in similarity with the work of
Samek et al. 2014, which proposed the robust spatial filtering of the motor imagery movements based
on the beta-divergence, the optimization of the Alpha-Beta Log-Det divergences is applied to this
problem. The resulting subspace algorithm provides a unified framework for testing the performance

Unsupervised Common Spatial Patterns
The common spatial pattern (CSP) method
is a dimensionality reduction technique widely used in
brain-computer interface (BCI) systems. In the two-class
CSP problem, training data are linearly projected onto direc tions maximizing or minimizing the variance ratio between
the two classes. The present contribution proves that kurto sis maximization performs CSP in an unsupervised manner,
i.e., with no need for labeled data, when the classes follow
Gaussian or elliptically symmetric distributions. Numerical
analyses on synthetic and real data validate these findings
in various experimental conditions, and demonstrate the

EEG signal processing in mi-bci applications with improved covariance matrix estimators
Article number 8688582n brain–computer interfaces (BCIs), the
typical models of the EEG observations usually lead to
a poor estimation of the trial covariance matrices, given
the high non-stationarity of the EEG sources. We propose
the application of two techniques that significantly improve
the accuracy of these estimations and can be combined
with a wide range of motor imagery BCI (MI-BCI) methods.
The first one scales the observations in such a way that
implicitly normalizes the common temporal strength of the
source activities. When the scaling applies independently
to the trials of the observations, the procedure justifies
and improves the classical preprocessing for the EEG data.
In addition, when the scaling is instantaneous and inde pendent for each sample, the procedure particularizes to
Tyler’s method in statistics for obtaining a distribution free estimate of scattering. In this case, the proposal pro vides an original interpretation of this existing method
as a technique that pursuits an implicit instantaneous
power-normalization of the underlying source processes.
The second technique applies to the classifier and improves
its performance through a convenient regularization of
the features covariance matrix. Experimental tests reveal
that a combination of the proposed techniques with the
state-of-the-art algorithms for motor-imagery classification
provides a significant improvement in the classification

Information Theoretic Approaches for Motor-Imagery BCI Systems: Review and Experimental Comparison
Brain computer interfaces (BCIs) have been attracting a great interest in recent years.
The common spatial patterns (CSP) technique is a well-established approach to the spatial filtering
of the electroencephalogram (EEG) data in BCI applications. Even though CSP was originally
proposed from a heuristic viewpoint, it can be also built on very strong foundations using information
theory. This paper reviews the relationship between CSP and several information-theoretic
approaches, including the Kullback–Leibler divergence, the Beta divergence and the Alpha-Beta
log-det (AB-LD)divergence. We also revise other approaches based on the idea of selecting those
features that are maximally informative about the class labels. The performance of all the methods

Segmentación rápida de huesos basada en regiones en imágenes TAC
En este trabajo se presenta una técnica de segmentación
automática de huesos en imágenes TAC sencilla y muy rápida
que permite implementar la segmentación de volúmenes TAC en
cuestión de pocos segundos.
La segmentación automática de estructuras óseas es de especial
interés para los radiólogos y cirujanos para analizar
enfermedades óseas o para planificar algunas intervenciones
quirúrgicas. Esta segmentación es una tarea complicada ya que
los huesos suelen presentar intensidades que solapan con las de
los tejidos circundantes (músculos, órganos, etc). Esta
superposición se debe principalmente a la composición de los
huesos y a la presencia de algunas enfermedades tales como
osteoartritis, osteoporosis, etc Por otra parte, la segmentación
de las estructuras óseas es una tarea que requiere mucho
tiempo debido a la esencia 3D de los huesos. Por lo general,
esta segmentación se implementa de forma manual o con
algoritmos usando técnicas simples tales como umbralización y
que por tanto proporcionan malos resultados.
En este trabajo, el algoritmo propuesto hace uso de técnicas de
umbralización, detección de bordes y análisis de regiones y es
comparada con varias técnicas presentes en el estado del arte
que utilizan Level Sets y algoritmos de maximización de flujo.
Para efectuar las comparaciones se han utilizado veinte
imágenes de TACs y se han calculado diferentes coeficientes
como DICE, sensitividad, sensibilidad y valor predictivo
positivo (VPP) para evaluar el rendimiento de nuestra
aplicación. Se obtuvieron los valores DICE y sensibilidad
